Artificial intelligence is entering a new era where we are no longer limited to answering questions or generating text,  agentic AI aims to act on our behalf in the real world. Imagine software that not only recommends travel options, but also books your tickets, manages payments, and navigates the messy realities of human preferences and ambiguity. 

This evolution promises major benefits, but also introduces profound scientific challenges that experts are only beginning to address. Insights from Amazon Research shed light on how this innovation will change the landscape of AI at work.

Key Challenges Shaping Agentic AI

  • Speaking the Language of AI Agents:
    Traditional chatbots operate in human language, but AI agents communicate more efficiently in embedding space ​(the mathematical representations of meaning). Each AI system may have its own version of these embeddings, making interoperability a challenge. Without a shared "language," agents can’t easily collaborate, highlighting the need for embedding standards and protocols.

  • Balancing Context and Privacy:
    To be effective, agentic AI must leverage context including personal preferences, past actions, and goals. Sharing too little context makes agents less useful while sharing too much could compromise privacy and performance. Since context is compressed into embeddings, it’s unclear how much sensitive information can be reconstructed. Differential privacy and new privacy-preserving techniques will be essential safeguards.

  • Negotiation and Strategic Interactions:
    Agentic AI will soon negotiate on our behalf helping to find deals, make purchases, or coordinating with other agents. While classic game theory assumes rational actors, both humans and AI often behave unpredictably. Insights from behavioral economics are key to designing agents that are not just efficient, but also fair and relatable in their interactions.

  • Internalizing Common Sense:
    AI still struggles with "common sense" (as do an alarming amount of people in this authors opinion), the unspoken rules we naturally follow. Agentic systems must grasp both general world knowledge and the unique habits of each user, such as daily routines or personal quirks. Translating these tacit expectations into explicit rules for AI remains one of the field’s toughest obstacles.

  • Embedding Standardization:
    Industry and research communities are working toward universal standards for embeddings, enabling more standardized agent communication and paving the way for an interconnected "agentic web." Specialized extensions may follow for sectors like healthcare or finance.

  • Privacy by Design:
    As agentic AI integrates deeper into our lives, privacy must be a foundational principle. New research is exploring how to limit information leakage from embeddings using algorithms that enforce privacy by default even as agents become more capable.

  • Behavioral Modeling:
    Future AI agents will draw on behavioral economics and mechanism design, ensuring their actions align with human expectations and social norms, not just mathematical efficiency.

  • Personalizing Common Sense:
    Empowering users to define their own "common sense" for AI agents, transforming instincts into actionable preferences, is a frontier challenge. Even advanced policy frameworks must bridge the gap between subjective habits and formal AI rules.
